Continuous Hidden Markov Models (HMMs) are powerful statistical models widely applied in speech recognition, bioinformatics, and financial forecasting. Implementing continuous HMMs in MATLAB requires focus on several core components: probability distribution modeling, state transition matrices, and observation sequence processing.
The key difference between continuous and discrete HMMs lies in how they handle observations. Continuous HMMs typically employ Gaussian Mixture Models (GMMs) to represent the observation probability distribution for each state. In MATLAB, this implementation can be divided into three main stages:
First is the model initialization phase. This involves determining the number of states in the model and setting initial probability distributions for each state. For continuous observations, each state requires assignment of a GMM containing multiple Gaussian distributions with mean and covariance parameters. MATLAB's Statistics and Machine Learning Toolbox provides functions like gmdistribution to simplify parameter configuration for these mixtures.
Second is the training phase. The Baum-Welch algorithm (a special case of the Expectation-Maximization algorithm) is used to optimize model parameters. This iterative process adjusts state transition probabilities and observation distribution parameters to better explain the training data. In MATLAB, developers can utilize built-in functions while implementing numerical stability measures, such as log-space computations using logsumexp to prevent underflow issues during probability calculations.
Finally, the decoding and application phase. The trained model can compute probabilities for new observation sequences or use the Viterbi algorithm to find the most likely state sequence. MATLAB's efficient matrix operations, particularly vectorized computations using bsxfun or implicit expansion, are crucial for handling the extensive probability calculations in HMM implementations.
When implementing continuous HMMs, several key considerations emerge: selecting appropriate numbers of Gaussian mixture components using model selection criteria like AIC or BIC, handling feature vectors of different dimensions through proper normalization techniques, and addressing numerical underflow problems during training by implementing scaling procedures or log-domain computations. These factors directly impact model performance and practical utility.
